There's a Cardenas super mercado in long beach near 7Th and another market that caters primarily to the Hispanic community near MLK. There's also a place in the old mall that sells Mexican candy. The ice cream vendors have a small selection also!!

Go to one of those stores that is in the middle of a Mexican neighborhood. You'll find it for sure. Or even a Mexican store that sells pinatas. I think they call their stores dulcerias.

Go to a Mexican bakery they always have dulces Mexicanos.
Or if you come to L.A. you will find it at Central Market
(On 5th and Broadway)
They have all kinds of candy.
