As long as the stamps are clean the stain doesn't matter

I just run my Technical Inspector stamp through the washing machine with old rags or a towel or two. We use black India Ink in the stamps, and the washing machine cleans the stamp pretty well. After it dries out, I just re-ink it.

Anything that removes the ink does so by degrading the surface of the stamp. It's better to leave the ink on than to peel away a layer of your stamp.

I use paper towels and Windex. Spray the paper towels then blot the ink stamp on the wet towels, then blot onto dry towels. On old stamps it takes awhile. I try to clean my stamps this way right when I use them.

A light solution ( mostly water ) of bleach and water. There is also a stamp cleaner available at your craft store. You can find it around where the ink is displayed.
